Large Language Models are neural networks trained on massive text corpora to understand and generate human language. They differ from traditional NLP models in scale, architecture, and the emergent capabilities that arise from training billions of parameters on diverse text data.

Traditional NLP models were typically task-specific. A sentiment classifier was trained only for sentiment analysis. A named entity recognizer learned only to identify entities. Each task required separate training data, model development, and deployment. These models had limited ability to generalize beyond their specific training objective.

LLMs take a fundamentally different approach. They are trained on a general objective, predicting the next token in a sequence, using enormous amounts of text from books, websites, code repositories, and other sources. This pretraining creates models that capture broad language understanding and can be adapted to many downstream tasks through prompting or fine-tuning.

The transformer architecture underlies modern LLMs. Self-attention mechanisms allow each token to attend to all other tokens in the sequence, capturing long-range dependencies that recurrent networks struggled with. Multi-head attention runs multiple attention operations in parallel, enabling the model to capture different types of relationships simultaneously.

Scale is a defining characteristic. Models like GPT-4 have hundreds of billions of parameters trained on trillions of tokens. This scale enables emergent capabilities that smaller models lack, including complex reasoning, following nuanced instructions, and few-shot learning where the model performs new tasks from just a few examples in the prompt.

Different architectures serve different purposes. Decoder-only models like GPT generate text autoregressively, predicting one token at a time based on preceding tokens. This makes them natural for generation tasks. Encoder-only models like BERT process entire sequences bidirectionally, making them effective for understanding tasks. Encoder-decoder models like T5 combine both capabilities.

The training process typically involves multiple stages. Pretraining on large text corpora teaches general language understanding. Supervised fine-tuning on instruction-following examples teaches the model to respond helpfully. Alignment techniques like RLHF further refine behavior to match human preferences for helpfulness, harmlessness, and honesty.

LLMs have transformed what is possible with language technology.
